Key takeaways

  • The algorithm. Run the draft M_q autoregressively for gamma tokens. Run the target M_p once on all gamma + 1 prefixes in parallel. Walk the guesses left to right, accepting token i when r_i <= p_i(x)/q_i(x) for r_i ~ U(0,1); at the first rejection, resample that position from an adjusted distribution and stop. Accept everything and you get a free gamma + 1-th token.
  • It is exactly lossless, and that is the whole point. The accept-reject rule is constructed so the sampled sequence has the target model’s distribution. Not approximately — the paper’s phrase is “without any change to the outputs”, and its headline result is measured against identical outputs.
  • It can never be slower in target evaluations. Each parallel run produces at least one token, so the number of serial target runs is bounded by what plain decoding would have taken.
  • The acceptance rate has a closed form: alpha = E(min(p, q)), one minus the expected value of a natural divergence between draft and target. That makes “how good must the draft be” a measurable question rather than a guess.
  • And so does the payoff. With cost coefficient c — the draft’s time per run over the target’s — the expected walltime improvement is (1 - alpha^(gamma+1)) / ((1 - alpha)(gamma*c + 1)). The optimal gamma maximises that, found numerically from alpha and c. For a negligible-cost draft the bound is 1/(1 - alpha).
  • The premise is a systems fact, stated plainly: inference from large models “is often not bottlenecked on arithmetic operations, but rather on memory bandwidth and communication, so additional computation resources might be available”. The method spends compute that was going to waste, which is also why its advantage narrows as the batch grows.
  • Evaluated on a 97M GPT-like model on lm1b, an 11B T5-XXL on translation and summarization, and a 137B LaMDA dialog task. Against the T5X implementation: 2x-3x latency, out of the box, no retraining and no architecture change.

Standing in the anthology

The trunk this record was missing. SOTA-227 is filed from it and from LIT-375; the reading is NOTE-160.

Filed under #87 after an audit found the record holding a refinement of this — LIT-185, EAGLE-3 — and four model reports that ship a draft head, with no document for the thing they refine and ship. DP-007 calls that shape “the refinement filed before the thing it refines”, and this is a worked example of it.
