Key takeaways

  • Instruction tuning, defined here. Fine-tune a pretrained model on a collection of tasks each verbalized through natural-language instruction templates — over 60 NLP tasks, on a 137B model — and evaluate on task types held out of that collection
  • It beats a larger model that was not tuned this way. FLAN surpasses zero-shot 175B GPT-3 on 20 of 25 evaluated tasks, and beats few-shot GPT-3 by a large margin on ANLI, RTE, BoolQ, AI2-ARC, OpenbookQA and StoryCloze
  • Three things are load-bearing, by ablation: the number of fine-tuning datasets, the model scale, and the natural-language instructions themselves. The third is the one that makes it a method rather than a mixture — the same tasks without the instruction phrasing do not do this
  • The supervision is existing labelled data, not new human effort. That is the whole economic difference from the preference line, and it is why the two answers were live at the same time

Standing in the anthology

The road not taken, filed because the record holds the comparison’s result and not its subject. LIT-377 reports FLAN at a 29.8 ± 2% win rate against its SFT baseline on the API prompt distribution, where InstructGPT reaches 73.4 ± 2% — and calls that “the comparison that decided the field’s direction”. A decisive comparison with one arm unfiled is a result the record can state and not interrogate.

compared_against rather than extends, under ADR-011: somebody ran this comparison, and InstructGPT is not built on FLAN. It is the alternative that lost on a particular distribution, which is a different relation and a more interesting one.

The comparison is LIT-377’s. On the OpenAI API prompt distribution, labelers compared 175B GPT-3 fine-tuned on the FLAN collection, and on T0’s, against InstructGPT’s SFT baseline: FLAN won 29.8 ± 2% of comparisons and T0 26.8 ± 2%, where InstructGPT won 73.4 ± 2%.

What the comparison does not say is the part worth keeping. The prompts were the OpenAI API’s, which is a distribution of what users actually asked for; FLAN optimizes zero-shot generalization to unseen academic task types. NOTE-161 already records the assumption that makes InstructGPT’s number mean what it means — “the prompt distribution used for training resembles the one the model will face … which is why the comparison against public-task instruction tuning goes the way it does”. So the record holds, in one place, a decisive result and the reason it is narrower than it reads.
