Key takeaways
-
The diagnosis is named and is not “low utilization”. Vanilla VQ-VAEs suffer low codebook usage “due to the poor initialization of the codebook”, so a significant portion of codes are rarely used, or dead. Dead codes shrink the effective codebook, which costs reconstruction in stage 1 and diversity in stage 2.
-
The causal claim the descendants dropped. “As a result, VQGAN relies on top-
kand top-p(nucleus) sampling heuristics with a default codebook size of 1024 to obtain best results for image synthesis.” Fix the codebook and the heuristics become unnecessary: this paper samples at temperature 1.0 with no top-kand no top-p, at codebook size 8192. The sampling tricks were compensating for a broken vocabulary. -
Factorized codes are not the same as small codes. A linear projection takes the encoder output to a low-dimensional lookup space (768-d → 32-d or 8-d), the nearest entry is found there, and the matched code is projected back up to the high-dimensional embedding space. The paper’s own framing: “decoupling code lookup and code embedding”. LIT-497 later reports the same effect with the whole codebook low-dimensional, which is a different implementation of the same idea and is worth not conflating.
-
ℓ₂-normalization turns Euclidean lookup into cosine similarity. Both encoder outputs and codebook entries are normalized onto a sphere, with the codebook initialized from a normal distribution, so theargminover‖ℓ₂(z_e) − ℓ₂(e_j)‖²is a cosine comparison. -
Table 4 is the ablation everything downstream is quoting. Base encoder and decoder, ViT, StyleGAN discriminator, throughput flat at 954–960 throughout:
lookup dim ℓ₂IS FID codebook usage 256 ✓ 160.1 3.68 4% 128 ✓ 173.9 2.77 14% 64 ✓ 179.5 2.50 37% 16 ✓ 191.2 1.50 95% 8 ✓ 189.5 1.52 96% 4 ✓ 143.8 3.68 96% 32 ✗ 123.6 5.44 2% -
The dimension-4 row is the one to read twice. Usage is 96% — the best in the table — and FID is 3.68, tied for worst among normalized rows. High utilization is necessary and not sufficient: below the optimum every code is used and none of them can say enough.
-
What it keeps of LIT-496, and what it swaps. The two-stage recipe is VQGAN’s — a quantized autoencoder trained with perceptual and adversarial losses, then an autoregressive transformer over the rasterized codes — and the title says it is improving that model. It replaces the CNN encoder and decoder with ViTs and the PatchGAN discriminator with a StyleGAN one, adds a logit-laplace term to the loss, and rebuilds the codebook as above. The headline numbers are measured against vanilla VQGAN.
-
Two other architectural findings. A ViT encoder-decoder beats the CNN on quality and throughput; a StyleGAN discriminator is more stable and better than the PatchGAN VQGAN used.
-
Headline: ImageNet
256×256→32×32codes, codebook 8192. Generation IS 175.1 and FID 4.17 against vanilla VQGAN’s 70.6 and 17.04. Representation: VIM-L linear probe 73.2% against iGPT-L’s 60.3% at comparable size, beating iGPT-XL trained on extra web data.
Standing in the anthology
The origin #243’s closing named and did not fill. Filing it turns
SOTA-306 from two independent measurements of somebody else’s
recommendation into a practice with its source, and corrects three things in
the process — the factorization, the standing of ℓ₂-normalization, and what
codebook utilization does and does not buy. That correction is the argument
for filing origins rather than only the papers that cite them.
It also carries β = 0.25 forward, “set to 0.25 in all our experiments”,
inherited from LIT-499 and not re-examined. That is now the third
paper in this record to pass the number along untested, which sharpens the
open question NOTE-245 filed rather than answering it.
What is not filed from it. The ViT-over-CNN and StyleGAN-over-PatchGAN
findings are single-paper architecture results inside one system, reported
without the sweep that would separate them from the rest of the changes, and
the record has no discriminator practice for them to join. The
VIM-L representation-learning half is a different claim again — a
linear-probe result the record’s own evaluation practices would want to
interrogate — and nothing here rests on it.
