The question, and it is one the record had no answer to. Why does CFG improve image quality rather than only prompt alignment? Boosting the class likelihood does not explain it: in the paper’s 2D example, guided samples are pulled toward the core of the manifold and away from low-probability intermediate regions, which class emphasis alone would not do.
-
The answer: the reference model is worse, and that asymmetry is the whole effect. The unconditional denoiser
D₀“faces a more difficult task of the two” — all classes at once — and “typically only a small slice of the training budget”, so it fits the data more loosely. Guidance pulls toward higherlog[p₁(x|c;σ) / p₀(x|c;σ)], and becausep₀is more spread out it falls off slower thanp₁away from the data, so the ratio’s gradient points inward. CFG is therefore “a form of adaptive truncation that identifies when a sample is likely to be under-fit and pushes it towards the general direction of better samples.” Filed as THEORY-112. -
Where the bad samples come from in the first place. Score matching is closely related to maximum likelihood, which is “conservative”: KL “incurs extreme penalties if the model severely underestimates the likelihood of any training sample”, so the model covers the data’s extremities it has not learned accurately. Those are the broken images. Compounding it, the network “has only seen real noisy images as inputs, and during sampling it may not be prepared to deal with the unlikely samples it is handed down from the higher noise levels”.
-
The quality gap is large and nobody reports it. EDM2-S on ImageNet-512: FID 2.56 class-conditional against 11.67 unconditional. The paper’s aside is the useful part — “the unconditional case tends to work so poorly that the corresponding quantitative numbers are hardly ever reported.”
-
The method. Guide the good model
D₁with a poor modelD₀trained on the same task, conditioning and data distribution, degraded by lower capacity and/or less training. For EDM2-S: an XS guiding model at 1/16 of the main model’s iterations. Both degradations together beat either alone. -
The mechanism is tested with a negative control, which is the rare part. Synthetic corruptions applied post hoc to one base model (EDM2-S, FID 2.56):
construction D₁D₀autoguided dropout 5% / 10% 4.98 15.00 2.55 at w = 2.25input noise +10% / +20% 3.96 9.73 2.56 at w = 2.00dropout vs input noise (mismatched) — — no improvement at any wCompatible degradations let autoguidance “largely undo the damage”. Mismatched ones leave the optimum at
w = 1, i.e. guidance switched off. The authors are explicit that they do not recommend synthetic degradations in practice — a real model will not have those particular defects. -
Results. ImageNet-512: EDM2-S 2.56 → 1.34, beating the concurrent CFG + Guidance Interval’s 1.68; EDM2-XXL → 1.25. ImageNet-64: 1.01 FID and 31.85
FD_DINOv2.FD_DINOv2record 29.16 → 24.18. -
It works on unconditional models, which CFG structurally cannot. Unconditional EDM2-S: 11.67 → 3.86. There is no condition to drop, and the method does not need one.
-
It depends on post-hoc EMA. The main and guiding models want independent EMA lengths; forcing them equal costs FID 1.34 → 1.53. So SOTA-428’s machinery is a precondition for getting the best out of this, not an optional extra.
-
Naive truncation is the wrong shape, and the paper shows why. Uniformly lengthening the score vectors by
w > 1— the GAN truncation trick’s analogue — concentrates samples “in an isotropic fashion that leaves the outer branches empty”, giving “reduced variation, oversimplified details, and monotone texture”. The density-ratio field is anisotropic and follows the manifold’s branching; a scalar does not. -
Two scope notes the authors volunteer. Discriminator guidance is outside the analysis, because there the discrimination is explicit rather than between
p₁andp₀. And noise-level-dependent guidance schedules exist mainly to suppress CFG at high noise, where differently-conditioned distributions diverge; autoguidance “is not expected to suffer from this problem at high noise levels, as both models target the same distribution”. -
The practical objection is theirs, not a reviewer’s. An early snapshot of a smaller model is “easy to satisfy in principle, but these are not available for current large-scale image generators in practice”, and staged training with changing data “would violate our assumptions”.
-
A cross-domain lead. Autoguidance “bears conceptual similarity to contrastive decoding used in large language models to reduce the repetitiveness of generations”. The record holds nothing on contrastive decoding.
Standing in the anthology
Filed on request, and it lands on the premise of a cluster built over the past day rather than on a gap in it. SOTA-424, SOTA-425, THEORY-110 and the guidance-scale dependents SOTA-202, SOTA-203 and SOTA-410 all take CFG’s fidelity-for-diversity trade as a given. This paper’s claim is that the trade is two phenomena stapled together by the choice of reference model, and that one of them is what everybody wanted.
What it supplies:
- THEORY-112, the mechanism account — the record held
THEORY-104(a consequence of a large guidance scale, for solvers) andTHEORY-109(a suspicion about the metrics) and nothing about why guidance works; - SOTA-433, the recommendation, with a compatibility condition that has a measured negative control behind it;
- the correction to two of SOTA-424’s Conditions — “conditional generation only” and “diversity is what is being spent” are properties of CFG’s reference model, not of guidance.
What it does not settle, and the paper says so. Whether diversity is really
preserved rather than merely FID-neutral. Its own future work names the
instrument: “it could also be interesting to further isolate the origin of the
improvement using alternative metrics, such as precision and recall, Human
Preference Score, or PickScore.” That is SOTA-425’s recommendation and part of
THEORY-109’s promote_when, asked for by the authors and not run — every number
here is FID or FD_DINOv2, both Fréchet distances that mix fidelity and
coverage.
