Key takeaways

  • The path decomposition. A depth-L, H-head self-attention network’s output is a sum over paths, each path a choice of one head per layer. With skip connections the path of length l count becomes C(L,l)·H^l, so short paths exist — including the path that skips every layer.
  • Theorem 2.2. For a pure self-attention network, ‖res(SAN(X))‖ ≤ (4γβ/√d_qk)^((3^L−1)/2) · ‖res(X)‖^(3^L) — a cubic rate, doubly exponential in depth. The authors’ rule of thumb: a linear rate needs about a dozen iterations to fall three orders of magnitude, a cubic rate needs two or three.
  • Skip connections are the thing that saves it (Claim 3.1): the length-zero path preserves the residual, so infinitely many parameterizations have ‖res(X_L)‖ ≥ ‖res(X)‖ even as L → ∞. A tight lower bound is posed as an open challenge.
  • MLPs help, at a price. The bound gains the MLP’s Lipschitz constant λ; more powerful MLPs slow the collapse. The authors state the cost themselves: larger Lipschitz constants make the model less robust and more sensitive to input perturbations, and raise gradient variance.
  • Layer normalization plays no role, and the argument is two lines: LN absorbs into W̃_h = W_h D_LN^{-1} plus a rank-1 shift, and right multiplication cannot increase rank.
  • Measured on BERT, ALBERT and XLNet, at initialization and pretrained.

Standing in the anthology

It is the trunk under a term the record was already using — for a different phenomenon. NOTE-105 and its source LIT-350 use “rank collapse” for weight matrices converging to low-rank subspaces during training. This paper’s rank collapse is token representations converging to rank 1 through depth in a forward pass, and it is prevented by the residual connection every real transformer has. Two phenomena, one name, and the record now holds both with the distinction written down.

It supplies a second, independent reason for skip connections. THEORY-011 holds that they smooth the loss landscape. This says they preserve rank, and says explicitly that this is “a previously unknown vital effect of skip connections beyond facilitating optimization.” Two accounts of one component, different mechanisms, no relation declared.

And the record holds its rejection without holding it. LIT-521 argues this account identifies the wrong locus — that the cause of a crash sits in the weight matrix rather than in the activations. That rejection has been in the record since earlier today with nothing to reject.

LIT-528 refines it rather than repeating it: without skip connections everything lumps into one tight cluster, and with them a classification of limiting geometries emerges.
