Contribution

The paper introduces Spectral Inference Networks, which learn eigenfunctions of linear operators by stochastic optimization. They generalize Slow Feature Analysis to arbitrary symmetric operators and are closely related to variational Monte Carlo in computational physics. Training is cast as a bilevel optimization problem so that several eigenfunctions can be learned online. Experiments on a quantum-mechanics problem and on synthetic video show that the networks recover the true eigenfunctions and find interpretable representations without supervision.

  • §3.1, eqs. 1–5: for a symmetric matrix the top eigenvector maximizes the Rayleigh quotient, and the top-N subspace maximizes Tr((UᵀU)⁻¹UᵀAU), which is invariant to right-multiplication of U by an invertible matrix.
  • §3.2, eqs. 6–7: with a “symmetric (not necessarily positive definite) kernel” and the inner product ⟨f,g⟩ = E_p[fg], the function-space objective is max Tr(E[uuᵀ]⁻¹ E[k(x,x′)u(x)u(x′)ᵀ]), equivalently max Tr(Π) subject to Σ = I.
  • §3.3, eq. 8: the graph-Laplacian kernel gives k·u(x)u(x′)ᵀ = (u(x)−u(x′))(u(x)−u(x′))ᵀ over neighbours; with adjacent frames as neighbours this is SFA. Eq. 9 gives the continuous Laplacian limit.
  • §4.1, eqs. 10–12: a Cholesky-based masked gradient breaks the GL(N) symmetry so that ordered eigenfunctions are learned simultaneously. §4.2: the bias from nonlinear functions of expectations is handled by bilevel optimization with moving averages of Σ and its Jacobian.
  • §5.2: on bouncing-ball video, “the time dynamics are reversible, and hence the transition function is a symmetric operator”. This is the paper’s explicit use of self-adjointness to license the method.

Open questions

  • It is the generic neural eigenfunction solver behind the SSL spectral reading. Johnson et al. (ra2, App. E.2) show that applying it to the positive-pair kernel recovers the same eigenfunctions contrastive learning targets.
  • Symmetry of k is a stated precondition, both for the Rayleigh-quotient characterization and in the video experiment. A deeper read should check what fails for non-reversible dynamics (the paper’s own RL comparison, App. C.3, uses successor features).
  • NeuralEF (Deng, Shi & Zhu 2022, arXiv 2205.00165) later replaced the Cholesky/Jacobian machinery with an EigenGame-style objective. It is not dossiered here.
